Personalized Persuasiveness Prediction

Personalized persuasiveness prediction is the task of estimating how persuasive a particular message, argument, or stimulus will be for a specific individual or audience segment, as determined by their psychological, demographic, historical, or latent characteristics. This field has emerged from empirical findings that persuasive success is not determined solely by message content or linguistic factors, but is modulated by the audience's values, cognitive preferences, personality traits, prior experiences, and context. Recent advances center on model architectures, inference workflows, evaluation metrics, and dataset construction to capture and exploit these user- or persona-specific determinants of persuasiveness.

1. Task Formulations and Representational Schemes

At its core, personalized persuasiveness prediction can be formalized as a supervised learning problem where the input comprises (a) a persuasive stimulus—textual, visual, or multimodal; (b) a structured representation of the target user's persona; and often (c) contextual information such as debate context or message history. The output is a numerical or categorical persuasiveness label, score, or ranking.

where x~\tilde{x} is the prompt constructed from pp, cc, and aa (Chan et al., 2024). In settings with richer user data, such as social media, the input persona may be represented as a concatenation of user profile fields and historical records, encoded using Transformer-based architectures and fused with message embeddings (Sun et al., 2023, Park et al., 9 Jan 2026).

In visual persuasion, the formulation expands to include the image II and fuses it with message MM and viewer characteristics pup_u (e.g., Big-5, PVQ-21, MFQ-30, demographics), with the model learning to predict scalar ratings or rank-order outcomes (Kim et al., 31 May 2025).

2. Persona and User Profile Representation

Persona modeling is central to personalized persuasiveness prediction. Effective approaches vary across contexts:

Consistent findings demonstrate that models leveraging individualized persona features—whether via prompting, fusion, or profile learning—outperform non-personalized or demographically-anchored baselines. Gains are particularly pronounced when persona modeling flexibly adapts to the target context (topic, domain, current claim). Performance typically saturates with 3–5 personas sampled or retrieved per instance (Chan et al., 2024).

5. Modeling Linguistic and Psycholinguistic Personalization

Persuasiveness adapts not only to topic and context but also to recipient personality. Large-scale analyses reveal that modern LLMs (across OpenAI, Anthropic, Meta, Alibaba families) adjust their linguistic outputs—e.g., anxiety terms for neuroticism, achievement for conscientiousness, cognitive-process word reduction for openness—to exploit psycholinguistic sensitivities (Mieleszczenko-Kowszewicz et al., 2024). Feature-based classifiers or neural models using LIWC-derived features, lexical diversity, and direct trait encodings can predict which outputs will score as persuasive with users of a given personality profile. Feature-trait coupling can be operationalized in algorithms via regression or Random Forests, and evaluated via AUC and Brier score.

A plausible implication is that such linguistic adaptation can be leveraged both for enhancing message effectiveness and for auditing model outputs for bias or manipulative risk. Ethical implications are non-trivial, as covert adaptation to personality—especially for high-neuroticism users—poses risks of manipulation and well-being erosion.

6. Extensions, Limitations, and Future Directions

Emerging and open directions include:

  • Dynamic persona tracking: Moving beyond static trait or history representations, modeling latent persona evolution during ongoing dialogue using continual estimation frameworks (e.g., time-varying OCEAN via DPPR) (Zeng et al., 2024, Zeng et al., 8 Apr 2025).

  • Manipulation and dark patterns: Adaptive message targeting may cross ethical boundaries, especially for users with high susceptibility (e.g., neuroticism, low self-control) (Mieleszczenko-Kowszewicz et al., 2024).
  • Transparency and consent: Regulations (e.g., EU AI Act) emphasize informed consent and the explicit flagging of personalized persuasive interventions.
  • Benchmarking and auditing: The development of benchmarks for “persuasion safety” and monitoring for abuse (e.g., persuasion-motivated misinformation) are active areas.
  • Generalizability and fairness: The ability of personalization frameworks to generalize across cultures, languages, and accessibility needs remains limited. Ensuring fair and non-discriminatory target representation is a significant challenge.
