2. Iterative Solution Algorithms and Data Searching

The canonical DD-FEM algorithm alternates two projections at each iteration:

  1. Projection onto Constraints (P_C): Given current states ziDz_i \in D, solve for admissible yi+1=PC(zi)y_{i+1} = P_C(z_i) by assembling and solving the finite element linear system, updating ε(e)\varepsilon(e) and σ(e)\sigma(e) with the prescribed offset and reference tensor.

Efficient nearest-neighbor (NN) search is essential for large data sets. Kd-trees provide O(logN)O(\log N) query cost on average, but degrade in high dimensions. DD-FEM applications routinely employ advanced data structures:

  • Randomized k-d trees and best-bin-first search
  • Controlled pruning with a backtrack-reduction factor fdf_d
  • kk-means trees with controlled bucket sizes and accuracy

Low-accuracy ANN is tolerable in early iterations, with search precision ramped up as convergence nears. Performance studies indicate speedups up to 106×10^6\times on billion-point datasets, with only minor loss of accuracy (few percent in the global objective) (Eggersmann et al., 2020).

Material data sets DD may be constructed from:

  • Direct experimental measurements of stress-strain (or higher-dimensional) response.
  • Microscale simulations, e.g., RVE studies of foams or architected metamaterials. For stochastic or inhomogeneous systems, data must densely cover the relevant phase space (Korzeniowski et al., 2021, Wattel et al., 2022).

In complex scenarios, state vectors may include additional fields such as strain-rate, damage, anisotropy, time-to-failure, or orientation—extending DD-FEM to model rate-dependence, degradation, and anisotropic phenomena without assuming empirical parameterizations (2002.04446).

Advanced DD-FEM strategies allow for nonuniform data coverage:

  • Unstructured data clouds can be managed via Delaunay triangulation or k-d trees for nearest-neighbor queries.
  • Data quality, gaps, or noise are directly reflected in solution uniqueness; uncertainty quantification may be achieved via MCMC-style perturbations (Kuliková et al., 22 Jun 2025).

For hybrid approaches, "data refinement" (d-refinement) converts elements from classical (model-based) FEM to data-driven elements when a nonlinearity trigger (e.g., stress threshold) is crossed, concentrating data-driven computation where material complexity demands it (Wattel et al., 2022).

4. Extensions: Multi-Scale, Non-Intrusive, and Machine Learning-Enhanced DD-FEM

Recent developments extend DD-FEM to broader settings:

  • Domain Decomposition and Structure Preservation: Subdomain approaches partition the domain; each local element is fitted (e.g., via Whitney forms) to Dirichlet-Neumann data, and global coupling is enforced using mortar or interface methods. Theoretical coercivity and error estimates are available even without explicit PDE knowledge (Jiang et al., 2024).
  • Hybrid Finite Element–Neural Network Methods: Parametrize unknown operators, coefficients, or constitutive relationships with neural networks, and embed them directly as components of the FE formulation while enforcing PDE constraints strictly. Gradient-based optimization is performed via adjoint differentiation across FE and NN blocks (Mitusch et al., 2021).
  • Goal-Oriented and Machine-Learned Discretizations: Machine learning is employed to optimize the test space (e.g., via parametric Petrov–Galerkin weights encoded in neural networks) for specific quantities of interest, enabling coarse-mesh accuracy beyond classical FE limits (Brevis et al., 2020).
  • Operator Learning and Surrogate Elements: Modular subdomain solvers based on neural operators, latent ODEs, or autoencoders are trained on small patches, then assembled non-intrusively into global solvers for unseen geometries and scales. Error estimation and adaptivity are central to practical deployment:

  • Parallelization at the integration-point or element level (for NN queries and data projection).
